Cool to see twisted SMC methods & framework applied to reasoning in math problems! builds on our ICML best paper award icml.cc/virtual/2024/oral/35…
🔍 Recent breakthroughs with O(1) in LLM reasoning have shifted the focus to efficient sampling techniques beyond just training! 💡 We introduce Twisted Sequential Monte Carlo (TSMC)-based verification—a new approach for multi-step reasoning. TSMC-based verification guides samples toward high-density regions using intermediate distributions, significantly boosting LLM performance. 📊✨ arxiv.org/abs/2410.01920 Learn more about how we're advancing step-wise LLM verification! 🔗👇

Small plug, not really advertised but we similarly showed how to perform temperature based control and composition of separately trained diffusion models via SMC and the Feynman Kac model formalism, with score distillation of the energy at AISTATS last year - Diversity control via temperature - Composition with SMC/ Feynman Kac, complementary to MCMC - Stable training of energy based diffusions via distillation, narrows gap to unconstrained diffusions on standard image datasets some thoughts 🧵 openreview.net/forum?id=6GyX… with @PreetumNakkiran @ArwenBradley @onloglogn @zhaisf @LouisBAlgue
Why do we keep sampling from the same distribution the model was trained on? We rethink this old paradigm by introducing Feynman-Kac Correctors (FKCs) – a flexible framework for controlling the distribution of samples at inference time in diffusion models! Without re-training or fine-tuning (just with the raw power of math), we demonstrate how to sample from: 1. product of densities (e.g. for conditioning generations on several things) 2. annealed density (invaluable property for diffusion-based samplers) 3. geometric-average of densities (to bridge the gap between classifier-free guidance and the common intuition) 4. reward-tilted density (easy to get within our framework, but we focus on other cases that don't require an external reward function) @martoskreto prepared beautiful animations for you in the thread below, or you can go directly to check - Paper: arxiv.org/abs/2503.02819 - Code: github.com/martaskrt/fkc-dif… - Educational example: colab.research.google.com/dr…

Given q_t, r_t as diffusion model(s), an SDE w/drift β ∇ log q_t + α ∇ log r_t doesn’t sample the sequence of geometric avg/product/tempered marginals! To correct this, we derive an SMC scheme via PDE perspective Resampling weights are ‘free’, depend only on (exact) scores!
🧵(1/6) Delighted to share our @icmlconf 2025 spotlight paper: the Feynman-Kac Correctors (FKCs) in Diffusion Picture this: it’s inference time and we want to generate new samples from our diffusion model. But we don’t want to just copy the training data – we may want to sample from an annealed distribution (e.g. to find modes), or combine two experts by sampling from the product of conditional densities (e.g. to design molecules that bind to two protein pockets). FKCs let us do this!✨But how? We explain in the 🧵 below. We are presenting 3 orals and 1 spotlight at #ICLR2025 on two primary topics: On generalizing the data-driven flow matching algorithm to jump processes, arbitrary discrete corruption processes, and beyond. And on highly scalable algorithms for reward-driven learning settings.

How annealing helps overcoming multimodality? In our ICLR 2025 paper openreview.net/forum?id=P6IV… and preprint arxiv.org/abs/2502.04575, we established the first complexity bound for annealed sampling and normalizing constant (⇔free energy) estimation under weak assumptions on target!

Got a diffusion model? What if there were a way to: - Get SOTA text-to-image prompt fidelity, with no extra training! - Steer continuous and discrete (e.g. text) diffusions - Beat larger models using less compute - Outperform fine-tuning - And keep your stats friends happy !?

Blog post: drive.google.com/file/d/17wP… Too technical for the newcomer? Too little detail for the expert? Dense notation? Probably all the above! But I've found this perspective beneficial to organize thinking across problem settings using a familiar language

🧵(5/5) The main result that unlocks all these possibilities is our new Itô density estimator, an efficient way to estimate the density of the generated samples for an already-trained diffusion model (assuming that we know the score). It does not require any extra computations, just the forward pass!

Simulation-free training for scientific problems with aligned data (e.g. transition path sampling)! stripping away the science applications, we learn a distribution path to solve Schrödinger bridge w/nonlinear reference drift and δ-fn endpoints (i.e. no coupling optimization)
Simulating protein folding between two metastable states is possible without any training data! Our #NeurIPS2024 spotlight paper brings us one step closer to this goal! arxiv.org/abs/2410.07974 This project would not see the light without @YuanqiD @MichaelPlainer @brekelmaniac

Come check out our presentations today! #ICML2024 Probabilistic Inference via Twisted Sequential Monte Carlo (Oral, 11:15-11:30, Hall A8) (Poster 814 morning) xitter.cf/AliMakhzani/status/178… Wasserstein Lagrangian Flows (Poster 1408 afternoon) xitter.cf/k_neklyudov/status/171…
Feel lost in all the kinds of optimal transport (OT)? Lagrangian flow is a single concept behind all of them. We (with @brekelmaniac) use it to propose a unified computational approach to - OT - Schrödinger bridge - OT with physical prior - unbalanced OT arxiv.org/abs/2310.10649

shout-out to these threads :) xitter.cf/andrewgwils/status/178…
I also do a double take every time someone uses "inference time" to mean "test time". I really dislike this change in terminology, which overloads the historical and more sensible meanings of the word "inference". When and why did it happen?

“How does it compare to flow matching tho?” Relating our Wasserstein Lagrangian flows (WLF) paper (which solves entropic, unbalanced, multimarginal OT w/spatial costs, w/@k_neklyudov) to concurrent work on Generalized Schrodinger Bridge Matching (GSBM) arxiv.org/abs/2310.02233
Introducing “Wasserstein Lagrangian Flows”: A novel computational approach for solving Optimal Transport and its variants. Paper: arxiv.org/abs/2310.10649 Led by @k_neklyudov and @brekelmaniac With: @AlexanderTong7 @lazar_atan @lqiang67 The solution of Optimal Transport (OT) and many of its variants, such as Schrödinger bridge, unbalanced OT, or OT with physical constraints, can be formulated as a curve on the density manifold that minimizes a particular Lagrangian action functional objective. We propose a unified computational framework for solving a very general class of action functional minimization problems, which also solves OT and its variants. We derive the dual objective of the Lagrangian on the cotangent space of the density manifold, resulting in a min-max optimization. It turns out the inner optimization, that evaluates the action functional, is a generalized “action-matching” objective, which we have previously shown to be tractable with a neural network parameterization: arxiv.org/abs/2210.06662. The outer optimization modifies the curve to minimize the action functional, subject to endpoint or multi-marginal constraints, using the reparameterization trick. The flexibility of the choice of Lagrangian in our framework gives us a principled way to incorporate different prior information in our problem, which finds many applications in AI4Sicence and generative modeling. We evaluate our method in trajectory inference problems in biological systems; and also show its applications in enabling fast one-step image generation. See Kirill’s thread for more details👇

GSBM tackles this in FM/BM framework using mixtures of bridges: - SDE sim for endpoint couplings - Gaussian ρ(xt | x0,x1) for tractable u(xt |x0, x1), parameterized by splines AM = match(ρt) can be used in line 3, but requires only samples
